In order to start finding this gems you must first get under the castle and be in the Forbidden Underground Waterway. Down here there are a few spots with Blue chests that have the potential to have multiple of each gem inside. The blue chests will respawn if you teleport away and come back. There are two key spots down there to get the chests.
The other spot you can get them down here is from the Shovel Knight wannabes. It is a low drop rate but if you are down there anyways you might as well kill some along the way. Find all the blue chests in the area, warp out and then warp back to get even more.
